Introducing Graph-Mamba: A New Graph Model Employing State Space Models SSM for Effective Data-Dependent Context Selection

The scalability of Graph Transformers in graph sequence modeling is hindered by high computational costs: a challenge that existing attention sparsification methods are not fully addressing. While models like Mamba, a state space model (SSM), are successful in long-range sequential data modeling, their application to non-sequential graph data is a complex task. Many sequence models show little to no improvement with augmented context length, underscoring the necessity of new strategies for long-range dependency capture.

Graph Neural Networks (GNNs) such as GCN, GraphSage, and GAT, have propelled graph modeling advancements by tackling long-range graph dependencies. However, the high computational costs of Graph Transformer models threaten their scalability. Alternatives like BigBird, Performer, and Exphormer counteract this challenge by introducing sparse attention and graph-specific subsampling, significantly lessening computational demands while preserving efficacy. These breakthroughs represent an essential shift towards more resource-efficient graph modeling methodologies, illustrating progress in the field towards scalability and efficiency issues.

A group of researchers has invented Graph-Mamba, a groundbreaking model that amalgamates a selective SSM into the GraphGPS framework. This offers an efficient fix to the challenges of input-dependent graph sparsification. By merging the Mamba module’s selection mechanism with a node prioritization approach, the innovative Graph-Mamba block (GMB) achieves superior sparsification, guaranteeing linear-time complexity. This positions Graph-Mamba as a robust competitor to traditional dense graph attention, potentially dramatically improving computational efficiency and scalability.

Graph-Mamba adaptively selects relevant context data and prioritizes important nodes, employing SSMs and the GatedGCN model for refined context-aware sparsification. Tested across ten diverse datasets, including image classification, synthetic graph datasets, and 3D molecular structures, Graph-Mamba exhibits superior performance and efficiency. It surpasses sparse attention methods and competes with dense attention Transformers due to its innovative permutation and node prioritization strategies are now being recommended as standard training and inference practices.

Experiments conducted on GNN and LRGB benchmarks validate Graph-Mamba’s efficacy, demonstrating its capacity to handle a range of graph sizes and complexities with lower computational demands. Importantly, it secures these accomplishments with significantly reduced computational costs, demonstrated by a 74% decrease in GPU memory usage and a 66% reduction in FLOPs on the Peptides-func dataset. These findings underscore Graph-Mamba’s competency in efficiently managing long-range dependencies, establishing a new benchmark in the sector.
